KARL: Reinforcement Learning for LLM Agents on Multi-Turn Knowledge-Intensive Agentic Tasks
Paper · 2026 · Xueqiao Sun, Xiao Liu, Bowen Lv et al.
Summary
LLM agents often handle knowledge-heavy tasks poorly because they consume external information passively. Retrieval is either fixed in advance or tuned only for single-turn question answering. KARL (Knowledge-Augmented Reinforcement Learning) addresses this for multi-turn work over structured sources such as knowledge graphs and databases. The agent learns to decide for itself when to query a source and what to look for, and its pool of gathered knowledge grows during the episode.
Training is online and end-to-end. Rollout generation and policy updates run asynchronously on separate resource groups, and every rollout executes in its own containerized environment with standardized tool interfaces. A curiosity-based reward bonus, added at the trajectory level, encourages exploring new and relevant knowledge, which counteracts sparse success-only signals.
A KARL agent built on Qwen2.5-14B beats GPT-4o, Claude-4 and o4-mini on in-distribution KG and DB tasks and generalizes well to unseen benchmarks. The study suggests that reinforcement learning, more than access to knowledge alone, is what teaches agents to use external context well.
Key points
- Training setup: the backbone is Qwen2.5-14B-Instruct trained with GRPO. Code is released at github.com/THUDM/KARL.
- Benchmarks: in-distribution results are reported on AgentBench KG and BIRD. To measure generalization, the authors evaluate on BFCLv3, both versions of Spider (1.0 and 2.0), AgentBench's DB task, and the WebQSP and GrailQA datasets.
- Value of RL: giving base or SFT-only models a knowledge source brings little or no gain and sometimes slightly lowers scores. Gains appear only after RL training.
- Reward ablation: the curiosity reward beats a binary success/failure reward (+1.0/0.0) on both KG and DB tasks. Dynamic knowledge exploration also outperforms static knowledge injected at the start of an episode, as well as RAG and RL-based search baselines.
- Limitations: a performance gap remains on out-of-distribution sets such as GrailQA and WebQSP, which the authors attribute to model scale and linguistic mismatch between datasets. The framework is limited to text, and extending it to multimodal settings is left for future work.
