Seq2Edits: Sequence Transduction Using Span-level Edit Operations
Paper · 2020 · Felix Stahlberg and Shankar Kumar
Summary
Many NLP tasks, such as grammatical error correction, produce outputs that are almost identical to their inputs. A standard seq2seq model still regenerates every token, which wastes computation and gives no reason for any change. Stahlberg and Kumar (Google Research) introduce Seq2Edits, which instead predicts a left-to-right series of span-level edits. Each edit is a triple: a tag that explains the change, the end position of the source span, and a replacement token. Special values mark kept spans (SELF) and deletions (DEL).
The architecture is a modified Transformer. The decoder is split into two stacks, with tag prediction and a pointer-network span predictor between them. Training minimizes the sum of three cross-entropies.
The authors test five tasks: text normalization (English and Russian), sentence fusion, sentence splitting, simplification and GEC. Results are competitive on all of them. The model sets new state-of-the-art results on text normalization, WikiSplit-style splitting and JFLEG. Because decoding cost grows with the number of edits rather than output length, GEC inference runs 2.0–5.2× faster. The tags also make each edit easier to interpret.
Key points
- Training data: English and Russian Wikipedia for text normalization (881K / 816K sentences), DiscoFuse (4.5M), WikiSplit (990K), WikiLarge (296K), and Lang-8 + FCE + W&I for GEC (2M).
- Model sizes: "Base" has 53M parameters and "Big" has 246M (excluding embeddings). Both use a 6-layer encoder; the decoder is split into parts A and B. Subword vocabulary size is 32K (Tensor2Tensor).
- Tag accuracy on BEA-dev: For GEC tag prediction, Seq2Edits reaches F0.5 51.2, against 48.8 for a BERT-initialized Lasertagger baseline. With gold spans supplied, F0.5 rises to 81.5.
- Russian text normalization: It gains less from oracle tags and spans than other tasks do. The authors suggest the main difficulty is predicting replacement tokens, likely because of Russian's rich morphology.
- Limitations: Outputs are less fluent than those of full sequence models, which matters for heavy rewrites. The custom architecture also takes engineering effort to implement efficiently.
