InferenceDynamics: Adaptive LLM Routing through Structured Capability and Knowledge Profiling

Paper · 2026 · Haochen Shi, Tianshi Zheng, Weiqi Wang et al.

Summary

Choosing which large language model should answer a given query becomes difficult as the number of specialized models grows. Binary strong/weak routers scale poorly to many candidates, and trained multi-model routers usually have to be rebuilt whenever a new model is added. InferenceDynamics addresses this by profiling both queries and models along two axes: capabilities and domain knowledge. An auxiliary LLM tags each query with ranked lists of the skills and knowledge areas it requires. Each candidate model then receives a profile score for every skill and knowledge area, based on its averaged results over repeated runs on an indexed dataset. These scores are discounted by tag rank and penalized for cost. New queries go to the model whose profile best fits their tags, so adding a model only requires scoring it, not retraining the router. The authors also built RouteMix, a routing dataset drawn from 24 benchmarks. On four out-of-distribution test sets, the router beat the strongest individual model. Under budget limits, it roughly matched that model at about half the expense.

Key points

  • RouteMix combines 24 public benchmarks. Routing is tested out-of-distribution on MMLU-Pro, GPQA, BigGen-Bench and LiveBench.
  • The candidate pool has 8 models: Grok2, Nova-pro-v1, Qwen-max, GLM4-plus, GPT-4o, Llama3.3-70b, Gemini1.5-pro and Qwen2.5-72b.
  • With optimal settings, InferenceDynamics scores 1.22 points higher on average than the best single LLM. In cost-aware mode, it performs comparably at roughly 50% of the cost.
  • The scoring uses two hyperparameters: α down-weights lower-ranked capability or knowledge tags, and β penalizes computational cost.
  • The authors analyzed 1,753 misrouted queries, with overlapping error categories:
    • near-ties within 0.005 of the selected model's score: 31.0%;
    • knowledge domains missing from the taxonomy: 41.5%, though the error rate stayed at about 12–13% either way;
    • residual errors, mostly on queries that very few models solve: 41.2%.
  • Code is available at github.com/HKUST-KnowComp/InferenceDynamics.
