Mitigating Tokenization-Induced Distance Distortion in Long-Context Multilingual Machine Translation
Paper · 2026 · Khotso Selialia, Antoine Nzeyimana and Fatima M. Anwar
Summary
Multilingual NMT systems lose quality as inputs grow longer. The authors trace much of this loss to the shared subword tokenizer. Morphologically rich source languages need far more tokens to express the same content. Standard positional encodings derive distance from raw token indices, so they treat related material as distant and weaken attention to it. The authors name this effect context-amplified translation degradation. Their fix is DCARPE (Dynamic Context Aware Relative Positional Encoding), a linear relative-bias scheme. A small MLP sets its distance-decay slope from two properties of each input: sequence length and fragmentation rate, meaning subword tokens per word. They build on NLLB and translate seven languages into English using JW300 data. Testing uses JW300 and out-of-distribution FLORES-200, with longer inputs made by joining 1–4 consecutive sentences. DCARPE consistently beats ALiBi and RoPE, and its advantage widens as context grows. It adds no meaningful computational cost and gives a cheap, architecture-independent way to make long-context translation more reliable for low-resource, morphologically complex languages.
Key points
- Source languages are Yorùbá, Kinyarwanda, Xhosa, Swahili, Turkish, Armenian and Greek. Each has roughly 60k–187k parallel sentence pairs, mostly from JW300.
- ChrF++ correlates almost perfectly with effective context length (Len/FragRate) in every language, with coefficients between −0.91 and −1.00.
- The largest gains over baselines are up to +10.81 ChrF++ and +8.00 BLEU. COMET shows the same ranking, while RoPE nearly collapses on BLEU for Armenian and Greek once three or more sentences are joined.
- The gains hold under full fine-tuning, LoRA and zero-shot cross-lingual transfer. They also carry over to a second backbone, M2M-100, with p = 0.009 against the baselines.
- Code and data are released at github.com/khotso1186/dcarpe. One limitation is that FragRate depends on word boundaries, so the method does not directly apply to unsegmented scripts such as Chinese, Japanese and Korean. Decoder-only LLMs have not been tested.
