Bringing Real-World Relations into Video Generation with Graph-Structured Knowledge
Paper · 2026 · Joonhyung Park, Jaeyun Song, Sihwan Park et al.
Summary
Open-source text-to-video diffusion models often produce physically implausible content, such as objects that appear from nowhere, float against gravity, or interact incoherently. Relying on ever larger models and curated video data to fix this is costly. The authors instead inject explicit relational knowledge. A vision-language model converts sampled frames into temporal video scene graphs made of subject-predicate-object triplets. Each graph also has two extra node types: a camera node, which tracks how entities move relative to the viewpoint, and a context node, which holds persistent scene information such as time, weather or background. Node embeddings from a graph neural network are fed into the video latent diffusion model through cross-attention. A new training objective, Graph-Aligned Denoising Loss (GADL), uses inpainting-edited video–graph pairs with added or deleted nodes so the model learns to follow the conditioning graph. Applied to Open-Sora and VideoCrafter2, the method improves object composition on VBench and wins most human preference comparisons. This suggests structured knowledge can partly substitute for brute-force scaling.
Key points
- The graphs encode entity triplets plus a camera node for viewpoint dynamics and a context node for persistent scene properties. They are extracted per frame by VLMs (Qwen2-VL / Qwen3-VL) and encoded with a GNN.
- GADL adds node addition and deletion tasks to denoising training. It relies on synchronized edited video–graph pairs created with a video inpainting model on segmentation datasets.
- On VBench, the authors report average object-composition gains of about 3.1% to 4.8% for the Open-Sora and VideoCrafter2 backbones.
- In a Prolific user study (20 participants, 50 videos), the method beat the baselines with an average win rate of 79.5%. Editing graph nodes at inference (replacing, adding or removing them) changed only the targeted entities in the generated video.
- The extraction pipeline was checked on 50 sampled graphs from ImageNet-VidVRD and VidOR. Precision was about 0.81 on ImageNet-VidVRD, which indicates few hallucinated relations. Long-video generation is left for future work.
