ERNIE-M: Enhanced Multilingual Representation by Aligning Cross-lingual Semantics with Monolingual Corpora
Paper · 2020 · Xuan Ouyang, Shuohuan Wang, Chao Pang et al.
Summary
Cross-lingual pre-trained encoders gain a lot from parallel data, but bilingual corpora are scarce, particularly for low-resource languages, which limits how well such models align meaning across languages. ERNIE-M, from Baidu, addresses this by bringing back-translation into pre-training itself. Built on XLM-R, it keeps the standard MMLM and TLM objectives and adds two new ones. The first, CAMLM, works on parallel pairs: it changes the attention mask so that masked tokens in one sentence must be recovered using only its translation. The second, BTMLM, reuses this ability on monolingual text. The model first predicts target-language tokens for a sentence, then joins those predicted tokens to the original as a pseudo-parallel pair for further training. This lets plain monolingual corpora supply alignment signal. ERNIE-M reports state-of-the-art results on XNLI, MLQA, CoNLL NER, PAWS-X and Tatoeba retrieval. This matters for languages like Ukrainian, where monolingual text is far more plentiful than parallel data.
Key points
- Ablation (base, initialised from XLM-R): with the full objective set, XNLI rises from 75.7 to 76.9 and CoNLL from 79.2 to 79.6. Adding BTMLM on top of CAMLM contributes +0.5 on XNLI. TLM alone actually lowered CoNLL to 78.3.
- Small models trained from scratch (6 layers): ERNIE-M reaches 69.8 on CoNLL, compared with 63.2 for XLM-R.
- Compute cost: ERNIE-M needs about 1.075x the compute of XLM-R (MMLM + TLM). At matched compute it still leads, scoring 69.9 vs 67.3 on XNLI and 69.7 vs 65.6 on CoNLL.
- Transfer gap (English minus other languages, averaged over MLQA and XNLI): ERNIE-M has the smallest gap at 11.9. The other models score 13.3 (InfoXLM), 14.0 (XLM-R) and 20.1 (mBERT).
- Pseudo-token share in BTMLM: generating more pseudo-tokens (tested from 5% to 20%) lowers perplexity and speeds convergence. Code and models are released in the PaddlePaddle/ERNIE GitHub repository.
