Routing with Generated Data: Annotation-Free LLM Skill Estimation and Expert Selection
Paper · 2026 · Tianyi Niu, Justin Chen, Genta Indra Winata et al.
Summary
LLM routers choose which model in a pool should handle a given query. Most existing routers learn from human-labelled, in-domain data, which is often unavailable when real user traffic is varied and unpredictable. The authors propose Routing with Generated Data (RGD). In this setting, a generator LLM writes queries, and optionally answers, using only short task descriptions, and routers are trained on that synthetic data alone.
Testing many routers shows a clear split. Routers that depend on answer labels lose accuracy quickly as the generator gets weaker. Routers that use only queries hold up much better. Weak generators turn out to write useful questions but unreliable answers. Good generators have two traits: they answer their own questions correctly, and their questions separate strong models from weak ones. Filtering generated data for these traits improves routing.
The authors also introduce CASCAL, a label-free router. It estimates correctness from confidence-weighted agreement among models and finds per-model skill niches through hierarchical clustering. Routing can therefore work without annotations.
Key points
- Evaluation setup: four benchmarks (MMLU-Pro, MedMCQA, SuperGPQA, BigBench-Extra-Hard) and 12 models, split into two pools of 6. One pool holds large models (>20B), the other small models (<10B).
- How CASCAL works:
- Each model's log-probabilities are Z-normalised.
- Matching answers pool these scores into a consensus score.
- Queries embedded with Qwen3-Embedding-8B are clustered into skill centroids, which are then merged and pruned.
- At test time, the top-3 (or top-1) models for the nearest cluster are selected and their outputs combined by consensus vote.
- Main result: on weak-generator data, CASCAL beats the best query-answer router by 4.6 points absolute. With data from Exaone-3.5-7.8B-Instruct on the large pool, it reaches 61.1%, compared with 57.1% for LLMRank and 58.9% for Avengers. Smoothie-Train serves as the query-only baseline.
- Effect of filtering: after filtering, small-generator queries can approach the routing quality of real queries.
- Limitations and code: experiments cover only English, closed-ended tasks. Code is available at github.com/tianyiniu/RoutingGenData.
