Skeleton-of-Thought: Prompting LLMs for Efficient Parallel Generation
Paper · 2023 · Xuefei Ning, Zinan Lin, Zixuan Zhou et al.
Summary
Answer generation in LLMs is slow largely because tokens are produced strictly one after another. This work tackles that bottleneck without modifying models, serving systems or hardware. Skeleton-of-Thought (SoT) is a two-stage prompting scheme inspired by how people outline before writing. First, the LLM drafts a brief numbered outline of its answer. Then each outline point is expanded at the same time, through concurrent API requests for proprietary models or batched decoding for locally run open-source models. The expansions are joined into the final response. Batching helps because decoding is limited mainly by loading weights, so larger batches barely raise per-token cost. SoT does not suit short answers or step-by-step reasoning, so the extension SoT-R adds a router (prompted or trained) that applies SoT only where it fits. Tested on Vicuna-80 and WizardLM across 12 LLMs, SoT cut latency substantially and often improved answer quality. The authors frame it as a data-centric route to faster inference.
Key points
- The evaluation covered 12 models: 9 open-source LLaMA-based models (7B/13B/33B, e.g. Vicuna, LLaMA2-Chat, UltraLM, OpenChat) and 3 API models (GPT-4, ChatGPT-3.5, Claude). The datasets were Vicuna-80 (80 questions, 9 categories) and WizardLM (218 questions).
- SoT gave more than 2× speed-up on 8 of the 12 models, peaking at 2.39× on average per model.
- On an example question, Claude's latency fell from 22 s to 12 s (1.83×). Vicuna-33B V1.3 on one A100 dropped from 43 s to 16 s (2.69×).
- Quality was measured as a net win rate with the FastChat metric. SoT-R improved answers for most models. Human judges rated 37/80 Vicuna-80, 58/218 WizardLM and 371/1030 LIMA questions as SoT-suitable.
- SoT-R's peak memory overhead stayed below 1.11×. Combined with GPTQ quantization, it reached 1.54–2.07× speed-ups over unquantized normal decoding.
