Learning Invariant Modality Representation for Robust Multimodal Learning from a Causal Inference Perspective

Paper · 2026 · Sijie Mai and Shiqin Han

Summary

Models for multimodal affective computing (sentiment, emotion, intention, and opinion prediction from language, acoustic, and visual signals) tend to latch onto shortcuts, such as a speaker who is always smiling. These shortcuts fail under distribution shift or corrupted inputs. The authors propose CmIR, a causal framework that splits every modality into two parts. The first is an invariant component whose relationship to the label stays the same across environments. The second is an environment-dependent spurious component. Training combines the task loss with three regularizers: an invariance term across simulated environments, a mutual-information penalty that decouples the two parts, and a reconstruction term that keeps the input information. The paper also proves that invariant representations exist and can be extracted, and that predictors relying on them achieve a smaller out-of-distribution risk in the worst case compared with predictors built directly on the original features. On CMU-MOSI and CMU-MOSEI, CmIR reaches state-of-the-art accuracy and is especially strong on out-of-distribution and noisy test data. This makes it relevant for real-world deployments where recording conditions vary.

Key points

  • On CMU-MOSI, the full model achieves Acc7 49.8, Acc2 89.6, and MAE 0.616, versus 46.3 / 85.8 / 0.681 for the vanilla framework. Removing any one of the three constraints lowers performance.
  • Under Gaussian noise (ratios 0.1–0.7), CmIR averages Acc2 87.0 on MOSI and 86.6 on MOSEI. This beats TMDC, C-MIB, and Multimodal Boosting, and its MAE grows far less as noise increases.
  • With OOD noise (Laplace noise plus random erasing), CmIR averages Acc2 86.7 on MOSI and 86.4 on MOSEI, again ahead of all three baselines.
  • Acc2 stays at or above 81% across a wide range of constraint weights and numbers of environments K. The invariance weight has the largest effect on results.
  • The authors note two limitations. Environments are simulated by perturbing features, and the mutual-information term is only approximated through feature orthogonality.
