Too Late to Train, Too Early To Use? A Study on Necessity and Viability of Low-Resource Bengali LLMs
Paper · 2025 · Tamzeed Mahfuz, Satak Kumar Dey, Ruwad Naswan et al.
Summary
The paper asks whether Bengali, a widely spoken but data-poor Indo-Aryan language, still needs its own large language model now that English-centric LLMs keep improving on other languages. The authors built a Bengali benchmark of NLU and NLG tasks, including translation, monolingual and cross-lingual summarization, paraphrasing, reading-comprehension and open-domain QA, natural language inference, and a new reward-modeling task derived from XLSum. On it they compared LLaMA-3 (8B/70B), Mistral, Aya-23, Qwen-2, NLLB, and GPT-family models against fine-tuned BanglaT5 and BanglaBERT. Where frozen LLMs lagged, they lightly fine-tuned LLaMA-3-8B with QLoRA.
Large LLMs were generally stronger on comprehension and reasoning. Their quality when writing Bengali text was uneven, and fine-tuned BanglaT5 still led on summarization and paraphrasing. The authors also found that Bengali is tokenized very inefficiently and that machine-translated datasets skew automatic metrics. They conclude that a Bengali-focused LLM is needed. However, building one is not yet feasible because high-quality pretraining and instruction-tuning data are missing.
Key points
- Tokenization: English-oriented BPE tokenizers average about 0.85 characters per token on Bengali, compared with about 4.5 for English. Because attention cost grows quadratically with sequence length, this makes Bengali processing expensive. BanglaT5 and NLLB are the exceptions.
- Best models per task:
- LLaMA-3-70B led on CrossSum, Squad-bn, and reward modeling.
- Fine-tuned LLaMA-3-8B-q4 led on BanglaRQA and XNLI-bn.
- GPT4 led on BEnQA.
- BanglaT5-248M-FT remained best on XLSum and BanglaParaphrase.
- Translation: On BanglaNMT, Google Translate beat all models by a wide margin, which the authors suspect may reflect data contamination.
- Dataset bias: Machine-translated sets such as BanglaParaphrase favor particular writing styles. This inflates BLEU and ROUGE scores for fine-tuned models regardless of how good the generated text actually is.
- Data gap: Bangla2B+ contains about 35 GB, against roughly 44 TB used for English pretraining, and the largest open English corpus (FineWeb) is 36.7 TB. Bengali also lacks RLHF data. Instead of training a model now, the authors recommend translation-plus-English-LLM pipelines and building a larger corpus.
