Timely Machine: Awareness of Time Makes Test-Time Scaling Agentic

Paper · 2026 · Yichuan Ma, Linyang Li, Yongkang Chen et al.

Summary

In agentic settings, LLMs call tools whose latency varies, so the length of a model's generation no longer reflects how long a task takes. Budgets based on token counts or numbers of tool calls therefore fail to capture the true cost. The authors propose Timely Machine, which treats test-time as actual wall-clock time and expects models to plan their behavior around a time budget. They analyze cases where tool latency dominates, where generation dominates, and where the two are comparable. They also build Timely-Eval, which covers interactive text games, machine learning tasks, and time-limited general reasoning, with tool delays that can be adjusted.

Experiments show a crossover. With fast feedback, smaller models can outperform larger ones because they fit in more interaction rounds. With slow feedback, larger models win because each step is of higher quality. Current models mostly fail to adapt their reasoning to the budget. To address this, the authors fine-tune on distilled time-constrained traces and then apply Timely-RL, a GRPO variant. This improves time-budget awareness and raises scores across Timely-Eval, which points toward agents that can be deployed in latency-sensitive environments.

Key points

  • Total cost is formalized as generation time plus tool time per step, using a latency ratio m_i = t_tool/t_gen. When m_i > 1, the model should focus on the quality of each call. When m_i < 1, it should shorten its reasoning to allow more rounds.
  • Timely-Eval components:
    • Jericho-based text games such as Zork, Advent, and Enchanter, with simulated delays and budgets set as multiples of each model's per-step latency τ.
    • Tasks adapted from MLEBench-Lite, for example Random Acts of Pizza, evaluated with ROC AUC.
    • General reasoning under strict time limits.
  • Cold-start data comes from AM-1.4M queries distilled with Qwen3-235B-Instruct-2507 using a Timer Tool. Time limits and timer acceleration factors were randomized during synthesis.
  • Distilled outputs were verified in two stages: first with math-verify, then with Qwen3-235B as a judge, which had to approve each answer in all 3 of its checks.
  • Timely-RL rewards models for making full use of the time budget. The authors plan to release the code, the distilled data, and Timely-Eval.
