RanLoRA: Residual-aware Nonlinear Low-Rank Adaptation

Paper · 2026 · Xu Luo, Yongbin Liu, Chunping Ouyang et al.

Summary

LoRA restricts weight updates to a linear low-rank subspace, which can limit how well it adapts to complex tasks, especially at very small ranks. Earlier nonlinear variants such as NEAT and AuroRA treat the adapter as one opaque transformation and ignore the internal structure of pretrained weights. RanLoRA addresses this with SVD. The pretrained matrix is split into a dominant principal part, which stays frozen, and a low-energy residual part. The residual singular vectors and values initialize the adapter matrices A and B. In the forward pass, the frozen principal weights are combined with a nonlinear residual branch: a GELU activation follows A, and its output is scaled element-wise by a learnable vector v (a Hadamard product) before B is applied. The authors describe the resulting training as progressive: it starts with a coarse fit and moves toward finer nonlinear refinement. Tests cover commonsense reasoning, NLU, mathematical reasoning and image classification. RanLoRA beats LoRA and recent variants at equal parameter budgets with little extra cost, which suggests that nonlinearity guided by weight structure is a cheap route to more expressive PEFT.

Key points

  • On LLaMA3-8B commonsense reasoning with 3.5M trainable parameters, RanLoRA reaches 87.2 average accuracy. The baselines score 83.6 (LoRA), 83.6 (MoSLoRA), 83.7 (NEAT) and 83.9 (AuroRA). All runs used the LLM-Adapters framework on an H800 GPU.
  • The method is efficient:
    • RanLoRA trains and tests in 6.9h using 30.2G of memory.
    • LoRA needs 6.6h and 29.6G.
    • AuroRA needs 11.8h.
  • Ablations show that each component matters:
    • Removing the modulation vector v causes the largest drop, −1.9 on ARC-c and −2.0 on BoolQ.
    • Dropping the activation costs 1.2 on BoolQ.
    • Replacing the residual-based initialization with Kaiming initialization also lowers scores.
  • Among the activations tried, GELU performs best, outscoring ReLU on OBQA by 1.2 points and on SIQA by 1.6 points. Tanh performs worst.
  • Performance holds up at very small ranks: rank 2 already averages 87.2, and rank 16 gives only a small gain to 87.9.
  • The authors list three limitations:
    • The one-time SVD adds preprocessing cost for huge models.
    • The choice of activation is empirical.
    • Encoder–decoder, speech and multimodal models were not evaluated.
