LLMs for Now, Fine-Tuning for Later: An Ensemble Approach to Data Drift in Domain-Specific Tasks
Paper · 2026 · Yuxuan Lu, Bingsheng Yao, Shao Zhang et al.
Summary
Real-world domain-specific deployments, such as clinical or legal work, face two problems. Expert labels are scarce, and the incoming data keeps changing over time (data drift). Active Learning (AL) can steadily improve a small model with expert labels, but each drift returns it to a weak cold-start state. LLMs work well immediately but cannot take advantage of new labels.
The authors first compared AL-assisted T5-base models with GPT-3.5 and GPT-4 on five legal and biomedical datasets. The LLMs lead early on. The fine-tuned compact model catches up and eventually wins once a few hundred annotations exist. Based on this timing pattern, they built an ensemble with three parts: an LLM using zero-/few-shot ICL, an AL-trained compact model, and a switch. The switch evaluates the two models against a continually refreshed validation sample and routes predictions to whichever one is performing better at that moment. It falls back to the LLM after a drift and returns to the compact model once that model recovers.
Under simulated drift on two mental health datasets, the switch picked the better model 96–98% of the time, and the ensemble beat both components used alone. The work shows how LLMs and expert-driven fine-tuning can complement each other in human-in-the-loop systems.
Key points
- The empirical study used BioMRC, CUAD, Unfair_TOS, ContractNLI and Casehold. These cover biomedical and law tasks (multiple choice, classification, NLI), with test sets ranging from 1,620 to 6,250 examples.
- AL compared a data diversity/similarity-based strategy, an uncertainty-based strategy and a random baseline. Each iteration added 16 labeled samples, and every setting was repeated 10 times.
- With only a few hundred expert labels, T5-base reliably surpassed GPT-3.5 and matched or beat GPT-4. In early iterations, every AL setting clearly trailed both LLMs.
- Drift was simulated as an abrupt flip of label proportions from 9:1 to 1:9. The size of the switch's validation sample came from a power analysis on Unfair_TOS.
- The authors list several limitations: only one compact model (T5-base), only two LLMs, only an extreme sudden-drift scenario, and only the mental health domain in the system evaluation.
