Process-Driven Autoformalization in Lean 4
Paper · 2024 · Jianqiao Lu, Yingjia Wan, Zhengying Liu et al.
Summary
Translating natural-language mathematics into formal code (autoformalization) has mostly been studied for languages with large online corpora, such as Lean 3. The newer and fast-changing Lean 4 lacks suitable training and evaluation data. The authors address this with two contributions.
The first is FormL4, a large dataset built from Mathlib 4 theorems. The theorems were automatically informalized, then filtered and partially checked by hand. Unlike earlier statement-only benchmarks, each item pairs a statement with its proof in both natural and formal language.
The second is Process-Driven Autoformalization (PDA). In this framework, a model trained on FormL4 produces Lean 4 code, and the Lean 4 compiler's error messages are turned into step-level labels. These labels train a process-supervised verifier (PSV), which then guides further fine-tuning of the autoformalizer. Compiling proofs together with statements exposes semantic errors that a statement-only syntax check would miss.
PDA raises compiler pass rates and human-evaluation scores while using less filtered training data, and it gains more from data that carries detailed process information. Because the compiler supplies the labels, this offers a cheap alternative to human or Monte Carlo Tree Search annotation of reasoning steps.
Key points
- FormL4 comes from Mathlib 4 and has three test splits: Random, Basic and Real. Both FormL4 and PDA are fully open-sourced.
- Data filtering removed failed or empty informalizations. It also removed items whose natural-language part was 400 characters or shorter, or whose formal part was 200 characters or shorter.
- Evaluation measures whether the statement and proof together pass the Lean 4 compiler. Metrics are greedy decoding (temperature 0.0) and unbiased pass@k (n = 20 samples, temperature 0.7).
- Baseline LLMs perform poorly on FormL4. The authors report a greedy score of about 10.2% for GPT-4 on the Real Test, compared with roughly 1.1% for the best open-source model, InternLM-Math-7B. LLEMMA-7B and LLEMMA-34B score near zero.
- Model size (7B–34B) showed little link to autoformalization quality in Lean 4.
