Task-Aware LLM Routing with Multi-Level Task-Profile-Guided Data Synthesis for Cold-Start Scenarios
Paper · 2026 · Hui Liu, Bin Zou, Kecheng Chen et al.
Summary
LLM routers pick a model from a candidate pool for each query, balancing answer quality against cost according to user preferences. Most routers are trained on labeled in-domain data, so they fail in cold-start deployments where no such data exists. The authors note that existing routers such as RouterDC and MetricRouter can generalize worse across domains than a simple rule-based baseline. Their solution synthesizes training data. An LLM, given only short domain descriptions, builds a three-level taxonomy of tasks (domain, subcategory, difficulty). A self-critique evaluator refines this taxonomy, and a generator then produces non-redundant question–answer pairs for each difficulty-level task profile. The candidate models are scored on these pairs to create routing labels. The paper also introduces TRouter, a regression-based router that predicts performance and cost through latent task-type variables, regularized by a prior over the synthesized taxonomy. Experiments cover several LLM pools and evaluation protocols. The results show that the synthetic data reduces cold-start problems and that TRouter yields higher routing utility whether or not in-domain data is available.
Key points
- Synthesis pipeline: The pipeline has three parts: a Task Type Generator, a Task Type Quality Evaluator, and a Question-Answer Pair Generator. Near-duplicate QA pairs are removed with a sentence-transformer when similarity to an existing pair exceeds 0.9.
- Value of difficulty-level profiles: Conditioning generation on difficulty-level profiles gives nearly linear growth in validated QA pairs. Domain- or subcategory-level profiles saturate because redundancy accumulates.
- Sample efficiency: The main experiments use 30 synthetic shots per task, but five or fewer shots already give near-optimal routing. Without the task prior, TRouter reduces to MetricRouter, which it beats at every shot count.
- Best taxonomy level depends on the setting:
- In-domain: difficulty-level task types give the highest utility sum (0.5925, versus 0.5641 for domain-level).
- Cold-start: domain-level types work best (0.5402, versus 0.5274 for difficulty-level).
- Evaluation and code: Candidate models come from the Qwen and Gemma families, and gpt-4.1-nano-2025-04-14 serves as the judge. The code is released on GitHub as ColdStartLLMRouter.
