Reflection in the Dark: Exposing and Escaping the Black Box in Reflective Prompt Optimization

Summary
Reflective automatic prompt optimization (APO) methods such as GEPA improve prompts by having an LLM reflect on failed examples. However, diagnosis and rewriting happen in a single unlabeled step, so it is unclear why a prompt changed or whether the search is stuck. The authors argue that this opacity causes four linked failures: a seed trap, an attribution blindspot, trajectory opacity, and transfer fragility.
They demonstrate the problem with GEPA's official GSM8K seed prompt. Its JSON schema places final_answer ahead of solution_pad, so the model's reasoning cannot shape its answer. GEPA never detects this defect, and accuracy drops.
Their remedy, VISTA, is a multi-agent framework built in three steps:
- one agent proposes hypotheses tagged with semantic labels taken from a heuristic set;
- another agent rewrites the prompt separately for each hypothesis;
- parallel mini-batch checks pick the best candidate, leaving an auditable trace.
Random restarts combined with epsilon-greedy sampling help the search escape local optima. VISTA restores high accuracy on GSM8K and beats GEPA on AIME2025. This suggests that structured, interpretable search makes prompt optimization more robust.
Key points
- Defective seed (Qwen3-4B base, Qwen3-8B reflector): GEPA lowers GSM8K accuracy from 23.81% to 13.50%, while VISTA reaches 87.57%.
- Minimal seed: GEPA barely moves (20.67% → 21.68%), whereas VISTA reaches 85.67%. This indicates the gains are not tied to the field-order bug.
- Other configurations:
- With a GPT-4o-mini reflector, GEPA reaches 23.43% and VISTA 87.64%.
- For prompts trained on GPT-4.1-mini and tested on Qwen3-4B, GEPA gets 22.74% and VISTA 86.05%.
- Ablation:
- The heuristic set contributes the largest gain (+59.81 points).
- Setting ε = 1.0 (pure exploration) drives accuracy down to 22.97%, whereas dropping exploration altogether has only a small cost (85.60%).
- K = 3 candidates works best.
- AIME2025: gains are smaller than on GSM8K. Under the repaired seed, GEPA even falls below the unoptimized baseline (39.33% vs. 40.00%).

- Heuristic coverage. The heuristic set has finite coverage; failure modes outside its scope can only be discovered via the ε-exploration branch, which has lower expected sample efficiency than heuristic-guided search.
