ProFit: Leveraging High-Value Signals in SFT via Probability-Guided Token Selection
Paper · 2026 · Tao Liu, Taiqiang Wu, Runming Yang et al.
Summary
Standard supervised fine-tuning (SFT) trains an LLM to reproduce one reference answer token by token. Valid alternative phrasings are therefore penalized, and the model tends to memorize surface wording. Training on several references per prompt could help, but the authors find it expensive and unstable. They instead try to reduce overfitting to the single reference.
Gemini-3-Pro labeled tokens in reference answers as core (carrying the reasoning) or trivial (replaceable wording). Probabilities from Qwen3-4B-Base showed that core tokens are predicted with much higher confidence. ProFit uses this finding: during training, it drops from the loss any token whose current predicted probability falls below a fixed threshold. A theoretical argument suggests that the large gradients of these tokens would otherwise dominate the update direction.
The method was tested on Qwen, Llama and OLMo2 models, using GPQA-Diamond, MATH-500, AIME'24, GSM8K and IFEval, among other benchmarks. It beat standard SFT and also served as a better initialization for later reinforcement learning. This makes fine-tuning on ordinary single-answer data more effective without collecting extra annotations.
Key points
- Token analysis: mean predicted probability was 0.768 for core tokens and 0.485 for trivial ones. A hypothesis test confirmed the two distributions differ (p = 1×10⁻⁶).
- Multi-reference pilot: training with 3 answers per prompt did not help consistently. On GPQA-Diamond it fell from 34.1% to 33.5% compared with single-answer SFT.
- Main results:
- On Qwen3 models, ProFit beat SFT by 3.0–10.9 points in average accuracy.
- On OlympiadBench it reached 24.3% Avg@4, against roughly 21.1% for competing methods.
- Fine-tuning already-aligned models (Qwen2.5-Instruct):
- SFT reduced the 7B average by 1.83 points.
- ProFit instead raised the average for the 0.5B (+1.24) and 7B (+0.17) models.
- Limitations: the assumption is aimed at logic-heavy tasks such as reasoning and math, and may not hold for creative writing. The probability threshold is fixed across all samples rather than adaptive.
