A Dynamic LLM-Powered Agent Network for Task-Oriented Agent Collaboration
Paper · 2023 · Zijun Liu, Yanzhe Zhang, Peng Li et al.
Summary
Multi-agent systems built on large language models usually rely on a fixed set of agents and a communication pattern that is designed in advance. This paper asks whether letting the team change, both in who joins and in how members interact, improves results. The authors propose DyLAN (Dynamic LLM-Powered Agent Network), which models collaboration as a temporal feed-forward network (T-FFN). In this network, each communication round is a layer and each agent is a node. DyLAN works in two stages:
- Team Optimization. Candidate agents take part in a preliminary run, and peer ratings are propagated backward to compute an unsupervised Agent Importance Score. The highest-scoring agents form the final team.
- Task Solving. The selected team collaborates. An LLM ranker removes weak agents mid-process, and an early-stopping rule ends the run once answers agree.
Using GPT-3.5 and GPT-4 backbones, DyLAN outperforms strong baselines on code generation, decision-making, general reasoning (MMLU) and arithmetic reasoning, at moderate API cost. The work shows that selecting agents based on their measured contributions can replace hand-crafted team design.
Key points
- Agent selection raised accuracy on individual MMLU subjects by up to 25.0 points (40.0 → 65.0). Other examples include management (76.2 → 90.5) and high school statistics (65.1 → 74.4).
- Early stopping reduced API calls by 45.0% (arithmetic reasoning), 66.2% (general reasoning), 11.3% (code generation) and 54.2% (decision-making). Agent team reformation contributed mainly to answer correctness.
- For open-ended outputs such as code, answer consistency is checked with BLEU at a 0.9 threshold.
- On code generation, DyLAN's performance stayed stable across backbone models, while Reflexion and CodeT varied considerably.
- The code is available at github.com/SALT-NLP/DyLAN.
