Benchmarking Generation and Evaluation Capabilities of Large Language Models for Instruction Controllable Summarization
Paper · 2023 · Yixin Liu, Alexander R. Fabbri, Jiawen Chen et al.
Summary
On ordinary news summarization benchmarks, modern LLMs appear to have hit a ceiling. Strong and weaker models receive similar human ratings, and annotators often disagree. The authors argue that generic prompts are too loose to separate models. They propose a harder setting, instruction controllable summarization, in which the model gets an article plus a natural-language requirement about content or format, such as a timeline or bullet points.
They selected 100 long English XL-Sum articles and wrote requirements for each by hand. They then had five systems ranked by humans on four quality criteria. Next, they tested LLM-based automatic judges against these human rankings.
Even GPT-4 still produced factual and other errors, and the systems differed widely in quality. GPT-4-based judges could order whole systems reasonably well. However, no automatic judge matched human preferences at the level of individual summaries, and judges were swayed by factors like summary length. The released benchmark, InstruSum, supports more realistic, user-oriented research on summarization and its evaluation.
Key points
- Dataset: 100 article–requirement pairs built from the English part of XL-Sum (BBC news). XL-Sum was chosen to reduce data-contamination risk. Articles average about 1,193 tokens and requirements about 15 tokens.
- Human annotations: InstruSum holds 500 summary-level annotations. They cover text-davinci-002, text-davinci-003, gpt-3.5-turbo-0301, gpt-4-0314, and a hybrid LLM-human summary. Each summary was ranked 1–5 on overall quality, missing information, irrelevant information, and factual consistency.
- Automatic judges: The study meta-evaluated 40 LLM-based evaluation methods, combining 4 protocols (e.g., G-Eval-style point-wise scoring and pairwise comparison) with 11 backbone LLMs. Pairwise comparison with GPT-4 proved the most dependable.
- Automated benchmarking: The authors used the best judges to rank 11 LLMs automatically. The results were unconvincing because of confounders such as output length.
- Release: The data are available at github.com/yale-nlp/InstruSum, and an evaluator leaderboard (InstruSumEval) is hosted on Hugging Face. LLMs were not meta-evaluated as factuality checkers, because factual errors in the benchmark were too sparse.
