Learning Language Specific Sub-network for Multilingual Machine Translation

Paper · 2021 · Zehui Lin, Liwei Wu, Mingxuan Wang et al.

Summary

A single multilingual NMT model often translates high-resource pairs worse than separate bilingual systems. The authors attribute this to parameter interference: many translation directions compete for the same weights. They propose LaSS (Language Specific Sub-network), which assigns each language pair its own binary mask over one shared mTransformer. To build a mask, a jointly trained base model is briefly fine-tuned on a single pair, and the lowest-magnitude fraction α of weights is pruned. Training then continues with batches that each hold one language pair, and gradients only update the weights selected by that pair's mask. Inference also uses only the masked weights. Some parameters end up shared and others specific to a pair, with no extra trainable parameters. Experiments cover IWSLT and imbalanced WMT data in a many-to-many setup. LaSS consistently beats the multilingual baseline, and rich-resource pairs gain the most. It also adapts to new pairs within a few hundred steps and substantially reduces off-target output in zero-shot translation. The work matters because it adds language-specific capacity without enlarging the model.

Key points

  • Data: 8 English-centric IWSLT2014 pairs (89k–169k sentence pairs each) and 18 WMT pairs, ranging from Gu (11k) to Fr (37m). They use BPE vocabularies of 30k (IWSLT) and 64k (WMT) and temperature over-sampling (T = 2 for IWSLT, T = 5 for WMT).
  • Models: Transformer-small for IWSLT, and Transformer-base and Transformer-big for WMT. The best pruning rate α was about 0.6–0.7 for IWSLT and 0.3 for WMT, so larger datasets need smaller pruning.
  • On WMT (36 directions), LaSS improves average BLEU by 1.2 with Transformer-base and by 0.6 with Transformer-big. The larger a pair's training data, the larger its gains.
  • Zero-shot translation, evaluated on OPUS-100 testsets, improves by 8.3 BLEU on average across 30 pairs, and by up to 26.5 BLEU. Translation-language accuracy rises sharply as well. Swapping masks shows that the decoder mask matters most.
  • The learned masks keep more language-specific capacity in the bottom and top layers. Code and models are available at github.com/NLP-Playground/LaSS.
