Can Multiple-choice Questions Really Be Useful in Detecting the Abilities of LLMs?
Paper · 2024 · Wangyue Li, Liangzhi Li, Tong Xiang et al.
Summary
Multiple-choice questions dominate LLM benchmarking because they are cheap to score. Real usage, especially in knowledge-heavy domains, usually demands free-form, multi-sentence answers. The authors test whether MCQ results reflect what models can do. They evaluate nine LLMs on four QA benchmarks in Chinese and English: CARE-MI, M3KE, ARC and a synthetic MATH set.
First, they swap the contents of the first two options, keeping D as the correct answer. A chi-squared test then checks whether the answer distribution shifts. Second, they compare MCQs with long-form generation questions (LFGQs) at three levels: final outputs, token probabilities and hidden-layer embeddings.
The models are sensitive to option order and, when wrong, lean towards the first position. Answers to the same question in MCQ and LFGQ form correlate weakly, and higher consistency does not mean higher accuracy. MCQs also show worse expected calibration error. The two formats occupy separable regions of the embedding space. The study warns that MCQ-only benchmarks may misjudge, and likely overstate, LLM abilities. It also proposes consistency and confidence measures that can be reused on other QA benchmarks.
Key points
- Evaluation subsets: CARE-MI (344, ZH), M3KE (299, ZH), ARC (291, EN) and MATH (300, EN), 1,234 questions in total. Only CARE-MI provides each question as an MCQ, an LFGQ and a TFQ.
- Order-sensitivity tests used GPT-3.5-turbo, GPT-4 and ChatGLM-6B, comparing the option orders ABCD and BACD.
- The same three models were used for the direct-output comparison. Only GPT-3.5-turbo was used for the token-logit and calibration analysis, which also varied the number of candidate options.
- The embedding analysis used per-layer t-SNE on ARC, with MCQs converted to LFGQs by hiding the options. Models included StableLM-Tuned-Alpha-3/7B, RedPajama-INCITE-Instruct-3B-v1, Llama-2-7b-chat-hf, Dolly-v2, Vicuna-7b-v1.3 and Open-llama-3/7B.
