Direct Speech-to-Speech Translation With Discrete Units
Paper · 2022 · Ann Lee, Peng-Jen Chen, Changhan Wang et al.
Summary
The paper tackles direct speech-to-speech translation (S2ST), which converts speech in one language into speech in another without producing text along the way. Earlier direct systems such as Translatotron predicted mel-spectrograms and performed worse than cascaded pipelines. The authors instead encode the target speech with HuBERT, cluster its 20-ms frame representations with k-means, and train a transformer speech-to-unit translation (S2UT) model to output these discrete unit sequences. A separately trained vocoder then turns the units into audio. Auxiliary multitask objectives support training. When target transcripts exist, a CTC text decoder attached to the unit decoder produces speech and text in a single pass. On Fisher Spanish-English, which uses synthetic single-speaker target speech, the approach beats a spectrogram-predicting direct baseline by 6.7 BLEU and matches an S2T+TTS cascade. It is also the cheapest system to run at inference time. A variant trained with no transcripts at all, using HuBERT units for the source as well, comes close to text-supervised spectrogram models. This result is promising for languages that have no writing system.
Key points
- The paper compares two unit-prediction strategies. In the "stacked" strategy, each decoding step predicts r units through a K × r output. In the "reduced" strategy, consecutive repeated units are collapsed into one.
- In the fully unwritten setup, an S2UT reduced model without auxiliary tasks reaches only 7.4 BLEU, and that score comes mostly from function words. Adding source units from an English-pretrained HuBERT as an auxiliary target narrows the gap to 1.4 BLEU on the test set. The comparison point is a transformer Translatotron that had access to text on both the source and target sides during training.
- Efficiency was benchmarked on an Intel Xeon Gold 6230 CPU. The test used three 500-utterance subsets of the Fisher dev set: random, shortest and longest. Against S2T+TTS, S2UT reduced runs 1.5X faster, uses 47% fewer FLOPs and needs 55% less peak memory.
- Against transformer Translatotron, S2UT reduced runs 1.3X faster, uses 39% fewer FLOPs and needs 51% less peak memory. In cascades, TTS is the main bottleneck, taking over 89% of runtime in S2T+TTS.
- The authors list two directions for future work: testing on real (non-synthetic) S2S data and handling voice and prosody.
