Graph-based Dependency Parsing with Graph Neural Networks
Paper · 2019 · Tao Ji, Yuanbin Wu and Man Lan
Summary
Graph-based dependency parsers score every possible head–dependent pair and then decode a tree. Their accuracy depends heavily on how each word is represented. Earlier encoders, such as BiLSTMs and the biaffine parser of Dozat and Manning (2017), mostly capture first-order parent–child information. Ji, Wu and Lan add higher-order structure, namely grandparents, grandchildren and siblings, without explicitly extracting features from a single intermediate tree.
They stack graph neural network layers, similar to a graph attention network, on top of a biaffine parser. Each layer works on a complete directed graph whose edge weights are the predicted head probabilities from that layer. The graph therefore acts as a "soft" parse tree that is supervised by a layer-wise loss. Head and dependent vectors are kept separate and updated through dedicated aggregation protocols, and the authors compare several aggregation and update variants.
On the English Penn Treebank, the parser reaches state-of-the-art accuracy among systems that use no external resources. It also gives small but consistent gains on multilingual UD data. This suggests that soft high-order information can be built into the encoder at low cost.
Key points
- PTB 3.0 results: 96.0% UAS and 94.3% LAS, the best reported among parsers that use no external resources.
- On 12 UD 2.2 treebanks from the CoNLL 2018 shared task, average scores rise from 88.89 to 89.13 UAS and from 85.96 to 86.24 LAS compared with the biaffine baseline.
- Architecture:
- a BiLSTM encoder takes random word embeddings, GloVe embeddings and POS embeddings;
- GNN layers using LeakyReLU follow the encoder;
- an MST decoder produces the final tree;
- labels are predicted as in Dozat and Manning (2017).
- Three high-order relations are modelled, grandparent, grandchild and sibling, by mixing neighbours' head and dependent vectors.
- Error analysis:
- gains come mainly from long sentences and long-range dependencies;
- the parser is slightly worse than the baseline on sentences of 10 words or fewer.
