TableLoRA: Low-rank Adaptation on Table Structure Understanding for Large Language Models
Paper · 2025 · Xinyi He, Yihao Liu, Mengyu Zhou et al.
Summary
Large language models often misread tables when tuned with parameter-efficient methods such as LoRA. Flattening a grid into a token sequence hides which cells share a row or column, and nested headers become hard to interpret. TableLoRA is a PEFT-compatible module that addresses these problems with two components:
- Special Tokens Encoder: Tables are serialized with dedicated [tab], [row] and [cell] markers instead of Markdown or HTML. A p-tuning-style scheme lets gradients reach the embeddings of these markers.
- 2D LoRA: Row and column indices are mapped to low-rank embeddings, projected up to the model dimension, and added at every layer alongside the standard LoRA branch. This gives the model explicit cell coordinates.
The authors tested the approach on three open models, including Llama, across four table QA and fact-verification datasets. TableLoRA beat vanilla LoRA consistently and also outperformed alternative table-encoding designs in controlled comparisons. It remains below full fine-tuning. The work matters because it improves table understanding in low-parameter, resource-constrained settings.
Key points
- Evaluation covered HiTab, WikiTQ, FeTaQA and TabFact. TableLoRA gained 5.9% over LoRA on HiTab, which contains hierarchical headers.
- Of the distance separating LoRA from full fine-tuning, it closes roughly 40.56%.
- On HiTab, the largest gains came on Argmax/Argmin queries (+17.2%) and on plain retrieval ("None") queries (+7.3%). Arithmetic queries such as Sum, Diff and Div stay weak, sometimes reaching 0% accuracy.
- Placing 2D LoRA in earlier layers works better than placing it in later ones. The gains over LoRA persist across different ranks.
- Code is published at github.com/microsoft/TableLoRA. Experiments were limited to open-source models; GPT-series models were not tested.
