STaR-SQL: Self-Taught Reasoner for Text-to-SQL
Paper · 2025 · Mingqian He, Yongliang Shen, Wenqi Zhang et al.
Summary
Text-to-SQL systems built on LLMs often depend on long, rigid prompt pipelines, such as GPT-4-based DIN-SQL. These pipelines consume many context tokens, are hard for smaller open models to follow, and tend to fail on complex queries. The authors instead treat SQL generation as a reasoning task. STaR-SQL adapts the Self-Taught Reasoner (STaR) recipe. A handful of annotated examples are used to prompt the model to write step-by-step rationales before the query. The model is then fine-tuned only on rationales whose SQL turns out to be correct. For questions it fails, the golden SQL is supplied as a hint so that useful rationales can still be harvested. The cycle is repeated with each improved model. At inference, several candidates are sampled and ranked by an outcome-supervised reward model (ORM), which spends extra test-time compute on accuracy. On the Spider dev set, the approach reaches 86.6% execution accuracy, outperforming GPT-4 prompting methods. The explicit rationales also make the generated queries easier for non-experts to check.
Key points
- Evaluated on the cross-domain Spider benchmark using execution accuracy (EX) and exact set match (EM). The full system scores 86.6 EX and 72.5 EM.
- STaR-SQL gains +31.6 EX over a few-shot baseline and +18.0 EX over a model fine-tuned to output SQL directly. It also beats DIN-SQL and the method of Gao et al., both of which use GPT-4.
- Bootstrapping needs only a tiny seed set of rationale examples (around 3). It adds golden-SQL hints and difficulty-based resampling for hard questions.
- In the ablation, removing rationales drops performance to 68.6 EX / 57.9 EM. Dropping best-of-N sampling gives 75.0 / 64.9. Using self-consistency voting instead of the ORM verifier gives 78.8 / 71.7.
- Stated limitations: only simple schema encoding was used. Stronger verifiers (process-supervised reward models, PRM) and search methods such as MCTS are left for future work.
