TATA: Stance Detection via Topic-Agnostic and Topic-Aware Embeddings
Summary
The paper addresses stance detection: deciding whether a text is Pro, Against, or Neutral toward a topic. The main difficulty is generalizing to topics the model has never seen or has only seen a few times. The authors propose TATA, which combines two pre-trained embedding layers.
- Topic-aware (TAW) layer: trained with a triplet loss on a new synthetic dataset built from unlabeled news articles. Topics are extracted with spaCy noun phrases refined by T5-Flan-XL, topic paraphrases come from Parrot, and similar passages are retrieved with MPNet and FAISS.
- Topic-agnostic (TAG) layer: learns general stance cues through contrastive learning on VAST extended with paraphrased texts.
Together, the layers give state-of-the-art results on VAST in both Zero-shot and Few-shot settings. TATA also leads competing models on the Zero-shot SEM16t6 benchmark. The work shows that cheap, automatically labeled topic data can replace costly annotated stance data for learning topic relationships. The authors release their code and data.
Key points
- The TAW dataset has 110,000 quadruplets (100k train, 10k validation), each holding a passage, its topic, a paraphrased topic, and a similar passage. It covers 97,984 unique topics, drawn from 15.90M news articles published between January 2022 and May 2023 on 3,074 sites.
- Similar passages had to come from a different website and reach a cosine similarity of at least 0.70.
- On VAST, TATA reaches F1 = 0.771 Zero-shot (prior best 0.723) and 0.741 Few-shot (prior best 0.715).
- On SEM16t6, TATA's average Pro/Against macro score is 0.588, compared with 0.505 for JointCL and 0.463 for TOAD.
- The model's accuracy on a topic did not depend significantly on whether that topic appeared in the TAW data (p = 0.353). The weakest case is passages expressing conflicting stances toward multiple topics.
