Fully Non-autoregressive Neural Machine Translation: Tricks of the Trade

Paper · 2021 · Jiatao Gu and Xiang Kong

Summary

Fully non-autoregressive translation (NAT) models produce every target token in a single parallel forward pass. This makes decoding much faster, but they trail autoregressive Transformers in quality because they assume target tokens are independent. Gu and Kong argue that the key design principle for such models is reducing dependencies in the output space. They revisit four families of techniques through that lens:

  • Data: knowledge distillation from an autoregressive teacher.
  • Model: VAE-style continuous latent variables, following Shu et al.
  • Loss: latent alignments via CTC.
  • Training: curriculum-based glancing targets (GLAT).

They then adapt these techniques so they work together. Across three benchmarks covering five translation directions, the combined system sets new state-of-the-art results for fully NAT models. Its quality is close to autoregressive and iterative NAT systems, while it keeps a large speed advantage. This matters because prior work showed that well-tuned autoregressive models erode the latency benefit of iterative NAT. Single-pass NAT is therefore the variant whose speed gain is real, and this work makes it competitive.

Key points

  • One model reaches 27.49 BLEU on WMT14 En-De and decodes 16.5× faster than a similarly sized autoregressive baseline on the same hardware and software. A vanilla NAT loses more than 10 BLEU.
  • In the ablations, knowledge distillation and CTC prove essential. Adding either VAE latents or GLAT on top gives comparable further gains, and GLAT outperforms random masking.
  • Switching to a stronger (big) distillation teacher barely helps the NAT student. Enlarging the NAT model itself improves accuracy beyond an AT (12-1) model with little added latency.
  • A PCA of the 8-dimensional latent variables shows that few dimensions are effectively used. Latents therefore need KD and CTC to be useful, and CTC-based models use more latent dimensions than AXE-based ones.
  • Remaining limitations include memory costs from CTC up-sampling and difficulty on harder pairs such as JA-EN. The implementation is released in fairseq.
