EventRL: Enhancing Event Extraction with Outcome Supervision for Large Language Models
Paper · 2024 · Jun Gao, Huan Zhao, Wei Wang et al.
Summary
LLMs used for event extraction (EE) often break the task schema. They attach arguments that a given event type does not allow, or they invent event types that the instructions never defined. The authors argue that Supervised Fine-Tuning (SFT) handles these errors poorly. Under NLL loss, a wrong type or role may differ from the gold output by a single token, yet that one token can ruin the whole extracted structure.
EventRL addresses this with outcome supervision. Training starts from an SFT checkpoint and continues with reinforcement learning, where the reward is computed from how well the predicted events match the gold ones (trigger and argument F1). Two mechanisms keep training stable: a Teacher-Force Threshold and Advantage Clipping. Prompts follow the hybrid format of Sainz et al. (2023): event schemas are Python dataclasses, instructions are in natural language, and outputs are lists of dataclass instances.
The method was tested on LLaMa and CodeLLaMa at several sizes, against SFT and GPT-4 few-shot prompting (FSP). EventRL beat the baselines, with the clearest gains on unseen event types and fewer schema violations.
Key points
- Three reward variants were compared: Argument-F1, Average-F1 (AVG-F1) and Product-F1 (Prod-F1). The choice of reward noticeably changes the outcome.
- In the error analysis, the baseline had 133 undefined-type errors and 51 structure-mismatch errors. The EventRL variants reduced these:
- Arg-F1: 99 / 50
- AVG-F1: 87 / 35
- Prod-F1: 78 / 43
- Code pretraining helps. At 7B with SFT, CodeLLaMa reached an AVG of 59.23 (Held-in) and 49.74 (Held-out), versus 56.03 and 37.35 for LLaMa. At 13B on Held-out, the scores were 51.69 versus 42.04.
- Larger models generally score better: EventRL (Prod-F1) rose from 60.72 at 7B to 65.90 at 13B on Held-in. However, CodeLLaMa-34B with SFT showed signs of overfitting, scoring 65.67 on Held-in but only 48.75 on Held-out.
- Stated limitations:
- The method depends on high-quality annotated data.
- Training cost grows as data volume increases.
- The gains are specific to EE and do not improve general LLM ability.
