Retrofitting Large Language Models with Dynamic Tokenization
Paper · 2025 · Darius Feher, Ivan Vulić and Benjamin Minixhofer
Summary
Most language models use a fixed subword tokenizer. This tokenizer often splits non-English text into too many pieces, which makes inference slower and more costly and spreads quality unevenly across languages. The authors adapt existing subword-based models to segment text adaptively, without retraining them. For each batch, a BPE-like procedure merges frequently co-occurring subword sequences into larger units. A pretrained hypernetwork from Zero-Shot Tokenizer Transfer (ZeTT) then builds embeddings for these new units at run time. The method suits cases where the whole sequence is known beforehand, such as classification, scoring and prefilling. For free-form generation, they offer a partial solution: a fixed vocabulary expanded to 1M tokens, searched with an approximate nearest neighbor index. With XLM-R across 14 languages, sequences become more than 20% shorter while accuracy falls by under 2%. With Mistral-7B, prefilling and scoring lose little quality. Main-model compute drops roughly in proportion to sequence length, and the hypernetwork adds little overhead. The approach offers a practical way to make multilingual inference cheaper and fairer.
Key points
- On the encoder XLM-R, token sequences shrank by 22.5% on XNLI and 26.4% on UNER, with minimal loss in task performance.
- On Mistral-7B, using hypernetwork input embeddings while keeping the original output embeddings worked best. This gave about 17% shorter inputs on MMLU and about 6% on MT-Bench, close to baseline. The FVT heuristic baseline deteriorated quickly once compression went beyond about 30% of the word-level maximum.
- For generation, the roughly 32k vocabulary was expanded to 1M tokens using BPE, longest-prefix tokenization and an ANN index. Sequences then approached word-level length, at a cost of 5.9% on MMLU (English) and 0.9 points on MT-Bench. The model's parameter count stayed unchanged.
- On multilingual MMLU in French, main-model FLOPs per sample fell from 14.4T to 9.7T. Hypernetwork FLOPs stayed below 3% of the total.
- Limitations: the method needs a pretrained hypernetwork for the target model, and per-batch vocabulary construction adds overhead, partly offset by an embedding cache. Code is released at github.com/DariusFeher/dynamic-tokenization.
