Data Filtering Networks
Paper · 2023 · Alex Fang, Albin Madappally Jose, Amit Jain et al.
Summary
Web-scale image-text pools are usually reduced to training sets with hand-crafted rules or with an off-the-shelf OpenAI CLIP model. This paper treats that reduction step as a learnable component. It calls the component a data filtering network (DFN): a model that scores each sample in the pool independently, so filtering parallelizes easily and its cost grows linearly with pool size.
The authors used the DataComp benchmark and its CommonPool of 12.8B Common Crawl pairs to test which properties make a filter effective. Their central observation is that strong downstream accuracy, such as on ImageNet, does not predict whether a model will select good training data. A compact contrastive model trained only on carefully curated pairs works better. Curated data also proved more valuable for training the filter than for direct use in training the final model.
Filtering with their best DFN produced DFN-2B and DFN-5B, whose CLIP models beat models of similar compute trained on LAION-2B, DataComp-1B or OpenAI's WIT. The work matters because it brings ordinary model-improvement methods to dataset construction and shows the approach works with fully public data.
Key points
- A ViT-H/14 trained on DFN-5B for 39B samples seen reaches 84.4% zero-shot ImageNet accuracy. A ViT-L/14 trained on DFN-2B for 12.8B samples gets 81.4%, more than 2 points above the best DataComp-1B ViT-L.
- The strongest DFN was trained on the internal HQITP-350M set. Training one DFN costs less than 1/50 of the total CLIP training budget.
- A ViT-B/32 DFN trained only on CC12M, CC3M and Shutterstock 15M equals or slightly exceeds OpenAI's ViT-B/32 as a filter at DataComp medium and large scales. At large scale the average is 0.532 vs 0.527.
- As the visual encoder in BLIP-2, the DFN-2B ViT-L beats OpenAI's ViT-L on zero-shot VQA, for example 48.3 vs 45.5 on VQAv2. It is also close to a larger EVA ViT-g trained on LAION-2B.
- DFN-2B is released publicly for research.
