STEMM: Self-learning with Speech-text Manifold Mixup for Speech Translation

Paper · 2022 · Qingkai Fang, Rong Ye, Lei Li et al.

Summary

End-to-end speech-to-text translation (ST) struggles with scarce labeled data. Transferring knowledge from strong machine translation (MT) models is also hard because speech representations and text embeddings occupy different regions of representation space. The authors propose STEMM (Speech-TExt Manifold Mixup) to narrow this modality gap.

A word-level forced alignment links spans of speech features to the matching sub-word embeddings. For each word, the model randomly keeps either the speech segment or the text embeddings, producing a mixed multimodal sequence. Both the pure speech sequence and the mixed sequence are passed through a shared translation encoder-decoder. A self-learning objective then combines cross-entropy on both inputs with a Jensen-Shannon Divergence term that pulls their output distributions together.

On the MuST-C benchmark, STEMM improves on a strong end-to-end baseline across eight translation directions and reportedly surpasses a strong cascaded system. Analysis shows that speech and text representations of the same words move closer together. The method offers a simple way to exploit MT knowledge in ST without architectural complexity.

Key points

  • Data and directions: Evaluation uses MuST-C, covering English into De, Fr, Ru, Es, Ro, It, Pt and Nl.
  • Architecture: A pretrained Wav2vec2.0 acoustic encoder is followed by two CNN layers that shrink sequence length by a factor of 4. The transformer translation encoder and decoder are pretrained on transcription-translation pairs plus external MT data, then the whole model is fine-tuned for ST.
  • Mixup ratio: Two strategies for setting the ratio p* are compared:
    • a static ratio shared by all instances;
    • an uncertainty-aware ratio derived from the average entropy of ST predictions.
  • Preserved MT ability: On the MuST-C En-De tst-COMMON MT task, STEMM scores 31.5 BLEU, close to 31.7 for the pretrained MT model. Plain ST fine-tuning (W2V2-Transformer) drops to 19.5 BLEU.
  • Effect of MT data and availability: ST BLEU rises steadily as more external MT pretraining data is added (up to 4M pairs). Code and models are available at github.com/ictnlp/STEMM.
