Sailor: Open Language Models for South-East Asia

Paper · 2024 · Longxu Dou, Qian Liu, Guangtao Zeng et al.

Summary

Most large language models are trained mainly on English text and underperform on South-East Asian languages. Sailor addresses this with a family of open models (0.5B to 7B parameters) built by continuing the pre-training of Qwen1.5 on 200B–400B tokens. Seven languages appear in the training data: English and Chinese, plus the South-East Asian languages Vietnamese, Thai, Indonesian, Malay and Lao.

The authors tested each technique on small models first. They kept the ones that helped:

  • heavy filtering and deduplication of the corpus
  • packing documents from different languages into the same training sequence (document-level code-switching)
  • stitching short adjacent paragraphs back together
  • BPE dropout, which makes the models less sensitive to how input text is split into tokens

A 120M proxy model was used to choose learning rates and the mix of languages. Expanding the vocabulary was tried and dropped.

On commonsense reasoning, question answering, reading comprehension and exam benchmarks, Sailor usually beats its Qwen1.5 base and is competitive with other SEA-focused 7B models, though not best on every test. The report openly documents failed experiments as well as successful ones, which makes it a practical guide for adapting LLMs to under-represented languages.

Key points

  • Data cleaning: The MADLAD-400 clean set was already curated, yet extra cleaning removed 31.11% of it and deduplication removed another 11.16%. Replay and translation sources included SlimPajama, SkyPile, Wikipedia, CC100 and OpenSubtitles.
  • BPE dropout: The models were first trained on 200B tokens, then tuned on 2B more tokens with a BPE dropout rate of 0.1. On TydiQA, Sailor-1.8B scores 40.88 EM without a trailing space in the prompt and 38.41 with one. Without BPE dropout, the trailing space drops the score from 38.94 to 18.76.
  • Code-switching: Document-level code-switching outperformed word-level replacement, where 10% of words are swapped for English. Using both together brought no further gain, so only the document-level method was kept.
  • Vocabulary expansion: Adding 15,000 subwords to Mistral and training on 20B tokens still left Thai question answering about 10% below the original model, so the approach was abandoned.
  • Sailor-7B results (3-shot):
    • XCOPA: 72.20 on both Indonesian and Vietnamese.
    • Belebele: 41.56 on Thai, compared with 38.33 for Qwen1.5-7B.
    • Some baselines beat it on particular tests. SeaLLM-7B-v2 scores 47.00 on Vietnamese Belebele, and Sea-Lion-7B scores 60.80 on Thai XCOPA.
