Adapting Large Language Models to Domains via Reading Comprehension
Paper · 2023 · Daixuan Cheng, Shaohan Huang and Furu Wei
Summary
The paper tests whether domain-adaptive pre-training (DAPT), which works well for encoder models, also helps generative LLMs. When LLaMA-7B was further trained on raw biomedicine, finance and law corpora, it gained domain knowledge: fine-tuning and knowledge-probing scores went up. However, its prompting performance on domain tasks mostly dropped. The authors trace this to raw domain text containing few varied input-output patterns, such as question–answer pairs.
Their fix copies how a student reads a text and then does exercises on it. Each raw document is automatically followed by tasks mined from it with regex-style patterns: summarization, word-to-text, natural language inference, commonsense/cause-effect reasoning, paraphrase detection and text completion. These reading comprehension texts are then mixed with general instruction data.
The resulting AdaptLLM improves consistently in all three domains. Its 7B version competes with much larger domain models such as BloombergGPT-50B. The recipe is cheap, works with any corpus and other base models, and even lifts general benchmarks. Model, code and data are public.
Key points
- Vanilla DAPT on LLaMA-7B (Table 1, domain averages):
- Prompting fell for biomedicine (44.2→41.7) and finance (58.6→57.6) but rose slightly for law (34.2→35.0).
- Fine-tuning improved in all three domains (64.2→66.5, 79.9→80.9, 42.0→45.4).
- LAMA-style knowledge probing rose for biomedicine (36.5→36.9) and law (45.0→45.6). No probing set was built for finance because supervised data there is scarce.
- QA-pattern tokens per million are far rarer in domain corpora than in general text: BioMed 22.5, Law 0.8, Finance 236.8, versus 490.26 in RedPajama.
- Verbalizer ablation: keeping only one template per task type cut mined examples from 2.1 to 1.4 per text. The average downstream score fell from 44.1 to 42.7.
- The method transfers to other base models:
- Pythia-70M.
- LLaMA-13B, trained with 512-token sequences and 40k steps.
- LLaMA-2-Chat-7B, with tasks recast as multi-turn conversations and one conversation per input to avoid gradient overflow.
- Resources are released at huggingface.co/AdaptLLM and github.com/microsoft/LMOps.
