Unsupervised Opinion Summarization as Copycat-Review Generation
Paper · 2020 · Arthur Bražinskas, Mirella Lapata and Ivan Titov
Summary
The paper tackles abstractive opinion summarization without any reference summaries for training. Gold summaries are costly to create, and review data covers many domains. The authors present Copycat, a model trained end-to-end only on large collections of product and business reviews from Amazon and Yelp. It is a hierarchical variational autoencoder. Each product has a continuous latent code capturing shared content such as sentiment and common topics. Each review has its own latent code that depends on the product code. A pointer-generator decoder can attend to and copy from the other reviews of the same product.
The idea is that a new review is produced from its sibling reviews plus some degree of novelty. At inference time the latent codes are set to their means, which suppresses novelty and yields a consensus-style "average" review that serves as the summary. Copycat beats MeanSum, the only earlier unsupervised abstractive multi-review system, in both automatic and human evaluation. Its summaries are better supported by the input reviews. The authors also release a set of abstractive summaries for Amazon products.
Key points
- Content support (human evaluation): sentences fully supported by the input reviews were 44.50% for Copycat vs 28.41% for MeanSum on Yelp, and 38.23% vs 24.41% on Amazon. Unsupported sentences were 23.01% vs 40.92% on Yelp and 27.83% vs 44.36% on Amazon.
- Ablations on Amazon: the full model reached ROUGE-1/2/L of 0.3197/0.0581/0.2016.
- Every variant scored lower: without z_i, without c, without attention over r_i, and sampling the latent codes instead of using their means.
- Removing the review-level latent z caused the largest drop.
- Removing the attention/copy component made summaries more generic.
- Mean vs sampling: sampling the latent codes produced longer, less fluent summaries that matched the input less well (ROUGE-1 of 0.2563).
- Copying behaviour: the model copies roughly 3–4 tokens per summary, mostly product-type words, brands and names.
- Comparison with LexRank: in the Amazon human study, LexRank was preferred overall. Its extractive summaries were about 20 tokens longer and covered more detail. Code and data: github.com/ixlan/Copycat-abstractive-opinion-summarizer.
