LLaVA Steering: Visual Instruction Tuning with 500x Fewer Parameters through Modality Linear Representation-Steering

Paper · 2025 · Jinhe Bi, Yujun Wang, Haokun Chen et al.

Summary

Multimodal LLMs built on the LLaVA recipe are expensive to adapt during visual instruction tuning, even with PEFT methods like LoRA. The authors examine attention distributions and find that text dominates output generation, while visual tokens get relatively little attention. This happens under both full fine-tuning and PEFT. They also observe that methods with better modality balance tend to need fewer trainable parameters.

Their method, MoReS (Modality Linear Representation-Steering), keeps the whole LLM frozen. At every layer, it applies a small learned linear transformation to visual representations inside a low-dimensional subspace, which pushes more attention toward the image. Following the LLaVA 1.5 training recipe, they build LLaVA Steering models at 3B, 7B and 13B scale. These models match LoRA-level results on standard visual benchmarks and VQA tasks while training several hundred times fewer parameters.

The authors also release the LLaVA Steering Factory, a modular open-source framework for assembling, training and analysing MLLMs. This matters for anyone fine-tuning vision-language models on limited compute.

Key points

  • Parameter savings: depending on the setup, LLaVA Steering trains 287–1,150× fewer parameters than LoRA, about 500× on average. For example, MoReS uses 0.328M trainable LLM parameters versus 188.7M for LoRA in the task-specific experiments.
  • Ablations: a subspace rank of 1 (0.164M parameters) gives the best average score of 81.8 across SciQA-IMG, VizWiz and the two IconQA variants. Steering only 1% of visual tokens works best and also lowers inference overhead.
  • Hallucination benchmarks: MoReS reaches 88.2 accuracy on POPE, ahead of full fine-tuning (87.2) and LoRA (86.7). It also leads on all three HallucinationBench splits.
  • Text-only tasks: because the LLM is frozen, text skills are preserved. MoReS scores HellaSwag 71.9 and MMLU 57.0, compared with 70.5 and 55.3 for LoRA.
  • Evaluation scope: the paper reports three visual benchmarks plus eight VQA tasks in the abstract, but six in the introduction. Code and the Factory are available at github.com/bibisbar/LLaVA-Steering.
