Efficient Large Scale Language Modeling with Mixtures of Experts
Paper · 2021 · Mikel Artetxe, Shruti Bhosale, Naman Goyal et al.
Summary
Making language models larger reliably improves them, but the training cost limits who can do it and raises energy concerns. This study asks whether sparse Mixture of Experts (MoE) models can match dense transformers at much lower compute. The authors trained GPT-3-style decoder-only dense models (125M–13B parameters) and FLOP-matched MoE models (15B–1.1T parameters). Every model saw 300B tokens from a 112B-token English corpus. They compared the two families on in-domain and out-of-domain perplexity, zero- and few-shot priming, and full fine-tuning.
MoE models were clearly more compute-efficient in every setting except fine-tuning. At small budgets they reached dense-model quality with about a quarter of the compute. The advantage shrinks as models grow, but the 1.1T MoE still beat its compute-equivalent 6.7B dense model. The size of the advantage differed widely across tasks and domains, which suggests the two architectures generalize differently. Code and models are released through fairseq, giving researchers a practical route to cheaper large-scale LMs.
Key points
- MoE design: every second transformer layer uses an MoE layer with 512 experts and top-2 routing. Expert capacity uses a factor of 2, and expert gradients are rescaled by 1/√E instead of reinitializing weights.
- Pretraining data: 453GB in total, drawn from BookCorpus, English Wikipedia, CC-News, OpenWebText, CC-Stories and English CC100. Sequences are 2048 tokens long.
- Efficiency: MoE models needed roughly 4× less compute at modest budgets. At the largest scale (around 5000 GPU days), the 1.1T MoE model still outperformed the 6.7B dense model.
- Fine-tuning: MoE models gained on StoryCloze, BoolQ, SST-2 and MNLI. They got worse on HellaSwag, PIQA and WinoGrande, whereas dense models improved on all of these tasks.
- Bias evaluation: on StereoSet and CrowS-Pairs, dense and MoE models showed similar levels of bias. Bias increased with model scale.
