Make Your LLM Fully Utilize the Context
Paper · 2024 · Shengnan An, Zexiong Ma, Zeqi Lin et al.
Summary
Long-context LLMs can accept tens of thousands of tokens, yet they often miss facts located in the middle of the input. This is known as the lost-in-the-middle problem. The authors argue that ordinary training data teaches models that key content tends to sit at the start or end of a context. To counter that bias they propose IN2 (INformation-INtensive) training, a method that relies only on data. They build synthetic long contexts of 4K–32K tokens by concatenating short ~128-token segments drawn from text. They then use GPT-4-Turbo to write question-answer pairs. Some questions target a single segment, and others require combining several segments scattered at random positions. Fine-tuning Mistral-7B this way yields FILM-7B. On the new VAL Probing suite, which covers documents, code and structured data with forward, backward and bi-directional retrieval, FILM-7B retrieves information reliably across its 32K window and rivals GPT-4-Turbo. It also improves on real-world long-context benchmarks without losing short-context ability. This suggests that synthetic data alone can repair positional blind spots.
Key points
- Training data comes from the realnewslike subset of C4. Questions are generated by GPT-4-Turbo and test either fine-grained awareness of one segment or multi-hop reasoning over two or more segments.
- VAL Probing has three tasks:
- Document Sentence Retrieval (bi-directional) over 800 sentences.
- Code Function Retrieval (backward) over 800 functions.
- Database Entity Retrieval (forward) over 750 entities.
- On real-world tasks, NarrativeQA F1 rose from 23.5 to 26.9. On short-context tasks, MMLU accuracy stayed essentially flat (59.3 → 59.2). In total, the evaluation covers nine long-context and eight short-context tasks.
- Ablations used 20% of the training data. A 4K sliding window sharply degrades retrieval beyond the window size, whether it is applied in pre-training or only during IN2 training.
- A larger RoPE base θ helped on VAL Probing in tests from 1.0×10⁶ to 1.0×10⁸. The authors recommend 10× the backbone's default; code is available at github.com/microsoft/FILM.
