On Difficulties of Cross-Lingual Transfer with Order Differences: A Case Study on Dependency Parsing
Paper · 2018 · Wasi Uddin Ahmad, Zhisong Zhang, Xuezhe Ma et al.
Summary
This paper asks whether neural parsers that rely heavily on word order lose accuracy when applied to languages whose ordering differs from the training language. The authors first build a word-order profile for each language from Universal Dependencies (UD) v2.2 treebanks. For fine-grained relation types, they record how often the dependent appears before its head, then compare languages using Manhattan distance. Clustering these profiles largely recovers the known language families. Next, they train parsers on English alone and evaluate them zero-shot on 30 other languages, including Ukrainian, with no target-language annotation. They compare four encoder–decoder combinations: a BiLSTM or a self-attention encoder (with relative position representations made direction-blind), each paired with a Stack-Pointer or a biaffine graph-based decoder. The order-free (self-attentive, graph-based) models transfer better overall, and their advantage is largest on languages far from English. RNN-based models stay competitive on close relatives of English. The results show that architecture choice matters when building parsers for low-resource languages.
Key points
- The study covers 31 UD v2.2 languages, each with more than 100K treebank tokens. They span Germanic, Romance, Slavic (including Ukrainian, Russian and Polish), Uralic, Japanese, Korean, Chinese and other families.
- Word-order vectors use the leftward-attachment frequency of 52 filtered (ModifierPOS, HeadPOS, DependencyLabel) triples. In the resulting clustering, German and Dutch separate from English, partly because they use more Object-Verb order in embedded clauses.
- The order-free encoder clips relative distances at k = 10 and uses absolute offsets. This gives k+1 position embeddings instead of 2k+1, so the model sees which words are nearby but not on which side.
- The input combines fixed multilingual word embeddings (Smith et al., 2017) with POS embeddings trained from scratch. The decoders follow Ma et al. (2018) for the Stack-Pointer and Dozat and Manning (2017) for the biaffine scorer.
- In an all-pairs experiment, a parser was trained on the first 4,000 sentences of each language. Average transfer performance correlated strongly and negatively with average word-order distance: Pearson −0.90 as source and −0.87 as target.
