RoBERT2VecTM: A Novel Approach for Topic Extraction in Islamic Studies

Paper · 2024 · Sania Aftar, Luca Gagliardelli, Amina El Ganadi et al.

Summary

The paper addresses topic discovery in Hadith collections. Classical Arabic morphology is rich, and most topic-modeling tooling assumes English-like languages. The authors take more than 14,940 Ahadith from Sahih Al-Bukhari and Sahih Muslim and keep only the Matn, the actual content, dropping the chain of narrators. The Matn is then cleaned in several steps: diacritics are stripped, characters are normalized, stopwords are removed and words are lemmatized with Farasa. Their model, RoBERT2VecTM, keeps the CombinedTM architecture (a Contextualized Topic Model built on ProdLDA) but changes its input embedding. The usual SBERT vector is replaced by a hybrid representation that merges a document-level Doc2Vec vector with RoBERTa token embeddings, then compresses the result with an autoencoder. On coherence (CV score), the hybrid beats CombinedTM with SBERT, RoBERTa alone, or Doc2Vec alone. The resulting topics can be grouped into recognizable Islamic domains. The authors also report that lemmatization and stopword removal strongly affect topic quality. The work belongs to the Digital Maktaba / ITSERR effort to automate metadata extraction for non-Latin scripts.

Key points

  • Corpus: Unicode editions of Sahih Al-Bukhari and Sahih Muslim, more than 14,940 Ahadith in total.

  • Isnad/Matn split: custom regular expressions separate the narrator chain from the content, and only the Matn is analyzed.

  • Preprocessing pipeline: diacritic removal, Unicode normalization, stopword filtering with nltk.corpus, and lemmatization with Farasa.

  • Embedding construction:

    • Doc2Vec produces a 128-dim document vector.
    • RoBERTa produces 768-dim token vectors, which UMAP reduces to 128 dimensions.
    • The combined vector passes through an autoencoder with a 64-unit ReLU bottleneck, trained for 200 epochs with Adam and MSE loss.
    • The final representation replaces SBERT in CombinedTM.
  • CV coherence (Table 4):

    EmbeddingCV score
    RoBERT2VecTM (Doc2Vec + RoBERTa)0.61
    SBERT0.55
    RoBERTa only0.54
    Doc2Vec only0.35

The comparative analysis with other approaches (Table 3) uses 50 topics.

Interesting ideas

  • I1. Before any semantic processing, the authors use surface-pattern rules to cut away the predictable "who transmitted it" frame (the Isnad), so content and provenance are handled separately.
  • I2. The hybrid is checked against each of its parts alone (Doc2Vec only, RoBERTa only) and against the standard SBERT setup, which shows the gain comes from the combination itself.
  • I3. The paper finds that lemmatization and stopword choices change topic quality noticeably, so preprocessing is treated as a factor to test rather than a fixed default.
  • I4. A document-level vector and token-level contextual vectors are projected into a shared size and fused, giving a representation with both a global and a local view of the text.
  • I5. The unsupervised clusters become interpretable because each induced topic is linked to a domain category that experts would recognize, for instance "Islamic Law and Society" or the category covering "Prayer and Worship".

For Mova

How these ideas could serve Mova, our small open language model — its files, stages and tests:

  • I1 (frames): reporting chains like "X said that Y told us that…" could be parsed as explicit nested attribution frames, so the embedded proposition is passed to the world separately from its source chain.
  • I2 (learn): any new combined component (e.g., merged witness parsers) could be evaluated against each member alone, so improvements are attributed to the merge rather than to one strong member.
  • I3 (tokens): ablate the lemmatizer and morphology settings in the en crate and measure the effect on downstream tree and frame accuracy, not just on token-level scores.
  • I4 (tree): gparse could receive a cheap sentence- or document-level context feature next to its token encodings, which might help resolve attachments that depend on the broader context.
  • I5 (world): clusters induced from texts could be anchored to WordNet/Wikidata ontology nodes, so every grouping carries an explainable label.
